It seems unusual https://books.google.com/ngrams/graph?content=our+physics+teacher%2C+our+teacher+of+physics&year_start=1800&year_end=2000&corpus=15&smoothing=3&share=&direct_url=t1%3B%2Cour%20physics%20teacher%3B%2Cc0 but if English natives will find it correct English it may be added in the future.
If this is still an open question, "teacher of physics" probably can safely be added as an alt. It's not as common -- not as common with "student" either -- but I don't think any harm would be done by accepting it (unlike in some other cases). https://books.google.com/ngrams/graph?content=physics+teacher%2Cteacher+of+physics%2Cphysics+student%2Cstudent+of+physics&year_start=1800&year_end=2019&corpus=26&smoothing=3&direct_url=t1%3B%2Cphysics%20teacher%3B%2Cc0%3B.t1%3B%2Cteacher%20of%20physics%3B%2Cc0%3B.t1%3B%2Cphysics%20student%3B%2Cc0%3B.t1%3B%2Cstudent%20of%20physics%3B%2Cc0#t1%3B%2Cphysics%20teacher%3B%2Cc0%3B.t1%3B%2Cteacher%20of%20physics%3B%2Cc0%3B.t1%3B%2Cphysics%20student%3B%2Cc0%3B.t1%3B%2Cstudent%20of%20physics%3B%2Cc0
